When AI agents shop and pay on their own, new security risks arise. According to a paper on arXiv (category cs.AI), these include forged agent identities, unauthorized payments, hijacked agents and the misuse of delegated authority. The authors present the ACAGS framework to address them.
What ACAGS combines
ACAGS stands for Autonomous Commerce Agent Guard System. It combines supervised machine learning, behavioral analysis, agent-specific authorization controls and explainable AI. Behavioral analysis here means that the system doesn't just check a single transaction, but also how an agent usually behaves. After comparing it with alternatives, the authors chose XGBoost as the classifier.
The result is one of three decisions: APPROVE, REVIEW or REJECT. SHAP explanations are meant to make it possible to understand why the model classifies a payment the way it does.
What the tests show
The tests used synthetic financial data, supplemented with simulated agent characteristics. Five attack scenarios were added. Over ten runs, the mean F1 score rose from 52.12% to 67.49% through behavioral features. With agent-specific features, it reached 69.46%. The F1 score summarizes how reliably a model finds fraud and how rarely it raises a false alarm.
Detection rates for individual scenarios varied widely:
- abnormal agent behavior: 99.77%
- identity forgery: 99.73%
- malicious delegation and violations of the authorization scope: 100%
- compromised agents: 72.27%
Hijacked agents are thus the hardest to detect. That is plausible, because a taken-over agent can initially appear legitimate.

Assessment
The figures come from simulations. The authors themselves stress that real transactions are needed for validation. For companies planning agents with payment authority, the work mainly offers food for thought. You can check how narrowly an agent's powers are defined, whether its behavior is monitored and whether its decisions can be explained later.
